I think something like "un-du® Sticker, Tape & Label Remover" would do the trick for you. It loosens the adhesive, but then the adhesive becomes sticky again when it dries.
I don’t know if you can find it in stores or if you have get it online, you might call your local hardware store and see if they have it.
